RAG & LLMs: Clearing Up (Mis)Conceptions for Business Leaders  

Before trying to understand what Retrieval Augmented Generation (RAG) is, it would be helpful to delineate what LLMs such as ChatGPT, Gemini and Claude are capable of, and more importantly, what they cannot do.  

People have a tendency to use LLMs like a search engine. This is primarily because, unlike actual search engines, they are able to provide a response to questions directly without users needing to click into any further links. But this highlights one of the biggest misconceptions surrounding LLMs, which is how they respond to prompts. LLMs do not understand the information they are responding to, they are using predictive methods to recommend what words semantically make sense as a response to a user’s prompt. In other words, it does not know what it\’s saying, it says what it has calculated to be probabilistically correct based on its training.  

Also, a somewhat natural limitation of LLMs is that their training data does not span all possible information. RAG is introduced precisely as a solution to tackle this limitation. 
 

What is Retrieval Augmented Generation (RAG)? 

RAG is a technique that gives LLMs the permission to reference information from external knowledge bases. A knowledge base is just a document or database that contains additional information that does not exist in the LLMs’ training data (eg. company-specific regulations/policies). RAG allows LLMs to integrate the information from these external knowledge bases in their responses to users.

Why RAG Matters for Business Leaders 

Think of LLMs as a student sitting a closed-book exam. They have done nothing but memorise selected parts of their textbook. Each prompt entered by a user is an exam question that an LLM is forced to dig into its memory to answer. RAG gives the student access to a cheat sheet that provides them with extra information that they did not memorise. The cheat sheet is not always going to help, but its presence ensures that a wider variety of questions can be answered.  

Leveraging RAG in Your Organisation 

One very useful application of RAG is through the use of Custom GPTs. Custom GPTs allow users to create their own ChatGPT model that is given specialised instructions. Apart from this, there is an option to provide them with an external database or document. RAG allows the custom GPT to tailor its responses around that external database. The following are some potential use cases: 

  • Analytics and Intelligence. Combine internal reports, customer feedback, and market data 
  • Executive Briefings and Summary. Auto-generate weekly strategy briefs from live dashboards, emails, or CRM systems 
  • Customer and Partner Support: Equip customer service and B2B teams with instant, accurate answers 
  • Compliance and Risk Mitigation: Ask compliance-related queries using your regulatory documents or legal archive 
  • Training and Onboarding: Smoothen the process of familiarising new hires with company specific practices and regulations 

Extending Beyond Internal Data: RAG & The Internet 

RAG empowers LLMs to deliver responses contextualised around organisation-specific data, significantly increasing their relevance and reliability. That said, it’s important to address how LLMs interact with the internet, one of the largest and most valuable external data sources, and how you can leverage it effectively. 

ChatGPT, for example, does not automatically reference the internet, but if prompted to, it will. This offers an endless variety of use cases. Here are a few such ideas:

  • Market Intelligence. Stay informed with real-time news, trends, and competitor updates from across the web. 
  • Customer Sentiment Analysis. Monitor reviews, forums, and social media to understand customer perception and adjust strategy. 
  • Regulatory Monitoring. Track legal, compliance, and ESG updates from government and industry sites to stay ahead of change. 
  • Vendor & Supply Chain Risk. Detect disruptions or risks in your supplier network by pulling alerts and news from external sources. 
  • Talent Intelligence. Track hiring patterns, skills in demand, and competitor recruitment strategies. 

An Honest Evaluation of RAG and LLMs in Enterprise 

While we have illustrated the benefits of RAG when used correctly, it is absolutely pertinent to acknowledge its limitations. After all, RAG is built as an ‘add-on’ for LLMs, which are themselves imperfect. By developing a holistic understanding of RAG, you can begin to adapt it more effectively for your own personal or business-related practices. The following are some legitimate limiting factors to be aware of: 

RAG’s effectiveness in using an external database is only as good as how structured and organised that database is. Referencing a poorly maintained database can lead to an LLM outputting partially or even fully incorrect answers. For example, a legal custom GPT referencing an unstructured contract database could miss crucial key terms or clauses. The main advice here is that if you are going to give an LLM access to a database, ensure that it is organised appropriately for the task at hand. This means, no missing or obsolete data, consistent paragraphing and font usage, Minimal use of images without descriptions (especially if the images are crucial). 

Even with RAG, LLMs do not understand privacy and security risks. They can often reference what may be sensitive internal data from a database. For example, A financial planning assistant for a company may be given access to individual payment records of other employees (which they are not authorised to see). This introduces a whole new dimension to the risk of security and compliance breaches. To avoid such scenarios, it is important to incorporate two fundamental safety-nets: role-based access control (RBAC) on databases and frequent compliance audits. In this context, RBAC involves defining access controls within the data system to restrict which queries an employee can make via the LLM. Having a human monitor and log all requests being made for a compliance audit ensures that if there are any breaches, they are quickly identified and fixed. 

The Path Forward with RAG and LLMs 

For business leaders, embracing RAG means unlocking the full potential of LLMs while addressing their blind spots. It’s not just about smarter AI; it’s about embedding contextual, organisation-specific knowledge to improve decision-making, compliance, and operational efficiency. 

However, RAG is not a silver bullet. Its effectiveness hinges on quality data and rigorous governance to manage risks around security and accuracy. 

The organisations that succeed in this AI-driven era will be those that pair innovative tools like RAG with disciplined practices, balancing ambition with responsibility. By asking the right questions and building robust frameworks now, you ensure AI is not only powerful but trustworthy and sustainable for the long haul.
